Efficient Generative Modeling, Classification, Denoising, and Information Processing via Compression

We'll explore the equivalence between lossless compression and statistical modelling, and how it can be leveraged to design principled, efficient schemes for modern machine learning tasks, including generative AI and classification. We'll see how, for some families of compressors and applications, the induced algorithms are competitive with state-of-the-art deep learning methods while requiring orders of magnitude less computation. We'll discuss theory, algorithms, and experiments that explain and quantify these statistical–computational tradeoffs, and use these insights to motivate extensions of classical universal compressors that preserve their theoretical guarantees while boosting their performance in practice. We'll then turn to the interplay between lossy compression and denoising, highlighting both classical and recent results justifying the intuition that well-designed lossy compression of noisy data results in denoising. In particular, we'll see that the reconstruction in such cases can be interpreted as an approximate sample from the posterior, yielding estimators performing well under both traditional distortion measures and modern perceptual criteria.
